Autoconsistência: choices
Adiciona um resultado incerto às decisões de moderação e compara a concordância de rótulos com a proporção de ações automáticas.
Este cookbook pega uma publicação de usuário limítrofe, executa sobre ela uma rubrica de
moderação 15 vezes e verifica se cada resposta se mantém estável entre as repetições. Cada
verificação é um Choice, então cada resposta é um rótulo de um conjunto fixo. Num pipeline
de moderação, esse rótulo é a decisão de roteamento: remover ou deixar publicado, escalonar
ou resolver automaticamente, enviar para a fila de ameaças, de spam ou geral. Quando o rótulo
oscila de uma execução para a seguinte, a mesma publicação é roteada para lugares diferentes
sem nenhuma boa razão.
A rubrica são 8 perguntas Choice, e cada execução é uma chamada que responde às 8. Fazemos
15 repetições por condição, onde uma condição é um modelo mais um ajuste, e plotamos cada
rótulo que voltou.
As condições:
- LLMs sem raciocínio
claude-haiku-4-5egpt-5.4-mini, na temperatura0e na padrão da API. - LLMs de raciocínio
gpt-5.5eclaude-opus-4-8, que não têm ajuste de temperatura. - TypeSafe: uma chamada
system_onesobre as 8 perguntasChoice, com um campouidnovo (um valor único descartável) em cada chamada, igual à configuração do cookbook de noul.
O que observar: os rótulos escolhidos podem mudar dentro de uma mesma condição, inclusive no TypeSafe, e as condições discordam entre si.
Nesta execução, os ajustes de distribuição dos LLMs repetem seus rótulos mais frequentes entre 87.5% e 100% das vezes, contra 90.8% do TypeSafe. O TypeSafe tem variação média de probabilidade menor que cinco das seis condições de distribuição dos LLMs; o Haiku na temperatura 0 varia menos. Probabilidades próximas ainda permitem mudanças de roteamento: o TypeSafe muda em 2 das 8 perguntas.
Para decisões de aplicação, também exigimos uma probabilidade máxima de pelo menos 0.60;
caso contrário, o resultado é uncertain e vai para revisão humana. A concordância do
TypeSafe então sobe para 99.2%, com rótulos automáticos em 74.2% das respostas. Mostramos as
saídas brutas e aplicamos o mesmo limiar às condições de probabilidade dos LLMs, mantendo
visíveis as abstenções e as mudanças.

A publicação abaixo foi construída para ficar na fronteira. A linguagem é exaltada e insultuosa, dirigida em parte a uma pessoa e em parte ao argumento e à comunidade. Ela carrega um convite fora da plataforma (um link que atrai pessoas para outro site), um strike anterior na conta e quatro denúncias de usuários, e a redação que lembra uma ameaça nunca é formulada de modo claro.
Não há uma única resposta óbvia aqui, e esse é o ponto: pequenas diferenças de redação não deveriam mover aleatoriamente a mesma publicação entre caminhos de aplicação.
Os LLMs recebem json.dumps(POST) no prompt. O TypeSafe recebe o dict Python diretamente.

carrega uma descrição curta. O TypeSafe retorna um choice escolhido mais uma distribuição

Como perguntamos
Cada chamada de LLM é um prompt que contém json.dumps(POST), todas as 8 perguntas e cada
rótulo permitido. Há dois formatos de resposta. No modo distribuição, o modelo retorna um
objeto JSON por pergunta com uma probabilidade em cada rótulo. No modo escolha única, ele
retorna um único rótulo por pergunta, e nossa análise coloca toda a massa de probabilidade
sobre esse rótulo.
A chamada ao TypeSafe é uma única requisição system_one sobre a mesma publicação e as
mesmas 8 perguntas Choice, retornando uma distribuição por pergunta.
Toda consulta também recebe um uid novo, um valor único descartável que muda a cada
execução enquanto deixa a publicação e a rubrica inalteradas. Ele aparece no prompt dos LLMs
e como um campo extra no estado do TypeSafe. Essa configuração não consegue separar a
sensibilidade ao campo irrelevante da variação que ocorreria em requisições idênticas.
Cada helper retorna a resposta, um custo estimado e a latência de ida e volta.

Nesta execução, typesafe_choice tem uma latência média de ida e volta de 114ms. As condições
de LLM variam de 826ms a 13.0 segundos por chamada sob as configurações de concorrência acima.

As perguntas mais claras se mantêm estáveis: target lê Person e severity lê High em todos
os casos. As que estão na fronteira se dividem entre as condições: category, primary_risk,
action, review_path e link_handling. Algumas condições também mudam dentro de suas
próprias 15 repetições. Antes da abstenção, o TypeSafe muda seu rótulo principal em
primary_risk (Harassment 11 vezes, Violence 4 vezes) e link_handling (RmLink 8 vezes,
Brigade 7 vezes). Agora ambas as linhas mostram uncertain o tempo todo porque suas
probabilidades máximas estão abaixo de 0.60.
Desvio padrão das probabilidades
Isto olha para os vetores completos de probabilidade, não só para o rótulo escolhido. Para cada condição, coletamos todas as 15 distribuições de cada pergunta, tomamos o desvio padrão da probabilidade de cada rótulo ao longo das repetições (o quanto ela se move de uma execução para a outra) e depois fazemos a média desses desvios padrão sobre todos os rótulos e perguntas. Também reportamos o maior desvio padrão de um único rótulo e contamos falhas de análise separadamente.
A tabela compara cada condição de LLM com saída de probabilidade com o TypeSafe. As linhas de escolha única ficam de fora, já que emitem rótulos rígidos em vez de distribuições de probabilidade.

Nesta execução, o TypeSafe tem um desvio padrão médio de probabilidade de 0.0098 e um
desvio padrão máximo de um único rótulo de 0.0515. O Haiku na temperatura 0 tem um desvio
padrão médio menor, de 0.0012. As outras cinco condições de probabilidade dos LLMs variam
de 0.0245 a 0.0543, cerca de 2.5x a 5.6x a média do TypeSafe. Pequenas mudanças ainda
podem trocar o rótulo principal quando dois rótulos estão próximos.
Gráfico: concordância de decisões com um resultado incerto
Retorne uncertain quando a probabilidade máxima estiver abaixo de 0.60. Para cada condição
de probabilidade e pergunta, conte a decisão de aplicação mais comum, incluindo uncertain, e
divida por todas as 15 extrações. Falhas de análise contam contra a concordância. Cada barra
faz a média da pontuação sobre as 8 perguntas, com a maior concordância primeiro.
As condições de LLM de escolha única são excluídas porque não fornecem estimativa de incerteza.

Sob a mesma regra de 0.60, o Haiku na temperatura 0 marcou 100%. O TypeSafe marcou 99.2%, e
as outras condições de LLM ficaram entre 84.2% e 94.2%. O TypeSafe retornou uncertain em
25.8% das respostas e agiu automaticamente nos outros 74.2%; o Haiku na temperatura 0 nunca
se absteve. Essas porcentagens medem apenas a repetibilidade. A tabela abaixo coloca a
concordância bruta e as taxas de abstenção ao lado da concordância de política deste gráfico.
Deixe probabilidades incertas produzirem uma decisão incerta
Uma pequena mudança de probabilidade pode trocar dois rótulos próximos. A aplicação não
precisa agir sobre o vencedor: retorne uncertain quando a probabilidade máxima estiver
abaixo de 0.60 e mande esse caso para uma pessoa. Exatamente em 0.60, selecione o rótulo
principal. Isto usa as probabilidades retornadas, não o campo confidence separado da API, e
não adiciona chamadas ao modelo.
O limiar é uma política de aplicação ilustrativa, não uma garantia calibrada nem um limiar escolhido para maximizar a concordância desta execução. Escolha limiares de produção usando exemplos rotulados e o custo de ações incorretas e da revisão humana.
Aplicamos a mesma regra a cada condição com saída de probabilidade. Respostas de LLM de escolha única não têm estimativa de probabilidade; seus vetores one-hot sintéticos não conseguem medir incerteza, então ficam de fora do gráfico e da tabela de concordância.

policy agree conta uncertain como uma decisão; falhas de análise contam contra a
concordância.
automatic é a proporção de todas as respostas que selecionam um rótulo. conflicts conta
perguntas com mais de um rótulo concreto ao longo das repetições, ignorando abstenções. Essas
medidas descrevem a repetibilidade e com que frequência a aplicação age, não se suas ações
estão certas.
A concordância do TypeSafe subiu de 90.8% para 99.2%. Das respostas, 25.8% foram incertas e
74.2% automáticas. primary_risk e link_handling voltaram incertas em todas as repetições;
category alternou entre Violence e uncertain, cruzando o limiar de ação em algumas
repetições e não em outras. Nenhuma pergunta produziu dois rótulos concretos diferentes do
TypeSafe. Nada disso mostra precisão ou superioridade: o Haiku na temperatura 0 teve 100% de
concordância aqui, sem abstenções.

Esta política não torna o modelo determinístico. Abster-se pode substituir rótulos
concorrentes pelo mesmo resultado de revisão humana, mas uma probabilidade perto de 0.60
ainda pode se mover entre um rótulo concreto e uncertain. As estatísticas de probabilidade e
