自動研究による特徴量発見

TypeSafe の質問を提案し、自由テキストを数値特徴量に変換し、モデルの誤差で教師あり CatBoost 回帰器を改善する自動研究ループを実行します。

TypeSafe の質問は自由テキストを教師あり CatBoost モデルの数値特徴量に変えます。自動研究ループを使ってそれらを見つけ出します。

CatBoost に必要なのは数値の表ですが、テイスティングノートはその表ではありません。この cookbook はノートに関する質問からその表を組み立てます。しかも質問は一つも手書きではありません。LLM が質問を提案し、TypeSafe がすべての行についてそれに答え、CatBoost がその答えで学習します。自動研究の部分はその次です。CatBoost がどの質問を使ったか、どの行をまだ間違えているかを報告し、次の提案呼び出しがその報告を読み、ループがまた回ります。

最後まで進めると、自分のラベル付きテキストに向けられるループ、ラウンドごとの留出誤差の曲線、そして最終モデルが最もよく使った質問の表が手に入ります。

score の答えは 2 列になります。答えが指す平均のレベルと、その平均の周りでのばらつきです。noul の答えは確率が 1 つなので、1 列です。

データは 2,000 件のワインレビューです。入力はテイスティングノート、出力は評論家の 80-100 点の評点です。RMSE は評論家の評点を点数で測る予測誤差の指標で、大きく外すほど重く数えられ、低いほど良い指標です。下の表の数値はすべて、モデルもループも一度も見ていない 800 件のレビューから来ています。

  • presence は Noul になります。欠陥が名指しされているかどうかといった真偽の事実向けです。列はその 1 つの確率です。

run_loop は 5 ラウンドすべてを実行し、ラウンドごとに 1 ブロックを出力します。追加された質問はそのまま入ります。答えはすでに取得済みで、尋ねる価値があったかどうかは後で重要度が示します。revise や drop は、モデルがすでに使っている列を奪うので、まずそれぞれを試します。変更を加えて再フィットし、dev 誤差が下がったときだけ残します。再フィットは API 呼び出しを消費しないので、変更を試して却下するのは無料です。

自分のデータに向ける

PROPOSER_TASK はワインに言及している唯一の文字列で、featurize() は任意の文字列リストを受け取ります。この指示文を編集すると提案プロンプトが変わり、プロンプトはキャッシュキーの一部なので、次の実行では毎ラウンド API を再び呼び出します。

リクエスト数は質問数ではなく行数に比例して増えます。1 ラウンドにつき 1 行あたり 1 リクエストなので、100,000 行なら 1 ラウンドで 100,000 リクエストです。revise は新しい質問として数えられるため、すべての行をもう一度なめることになります。ワーカープールはゆっくり増やしてください。共有キーでは、8 でもレート制限に達するのに十分です。

評点の範囲を四等分する各位置から 1 件ずつ取った留出レビュー 5 件を、38 個の質問のうち 15 個と突き合わせます。重要度上位 8 個の score 質問と、上位 7 個の noul です。

この 15 行は、答えが評論家の評点とどちらの向きに動くかで並べ替えられます。評点とともに答えが上がる質問が先に来て、評点とともに下がる質問は区切り線の後に来ます。つまり、最悪のレビューから最良のレビューへと左から右に見ていくと、区切り線より上の答えは上昇し、下の答えは下降するはずです。

ページ冒頭の表を実際に計算したものです。5 つのアームはすべて同じ 800 行の留出行で一度だけ評価され、最初の 3 つは特徴量発見を行いません。1 つは dev 評点の平均を予測し、ノートからは何も読みません。1 つは同じ CatBoost にノートを text_features の仕組みで渡し、単語数に変換します。1 つは TypeSafe に評点そのものを尋ねます。

3 つ目は、行ごとに 1 つの Score で、10 段階の品質帯を「faulty or unpleasant」から「profound」まで評価します。10 なのは、Score の質問が受け取れるレベルの最大が 10 だからです。11 にするとサーバーエラーが返ります。レベル 0 が 80 点、レベル 9 が 100 点に対応します。帯をこうして尺度上に広げるだけでは不十分です。この媒体の評点が実際に尺度上のどこにあるのかを、質問は何も語っていないからです。そこで各答えは、dev 評点で測った 1 つのオフセットで動かします。そのオフセットは行ラベルに出力され、この近道が評点から学ぶのはそれだけです。

自動研究のラウンドは役に立ったか

どちらの線も、最初の提案から始めて、各ラウンド終了時点の質問集合の誤差を描きます。破線は交差検証した dev 誤差で、accept と reject のあらゆる判断がこれに基づいて下されます。実線は同じ質問集合を、ループが一度も読まない留出行で評価したものです。各点はラウンドが終わった時点の集合なので、revise や drop だけを行ったラウンドでも両方の線が動きます。特徴量マップは質問が何を測っているかを示し、誤差は最初の提案より後のラウンドが予測を良くしたかどうかを教えてくれます。

軸は狭く取ってあります。ここで起きていることはすべて 1/5 点の内側で、上の表の近道はどれもはるか上方に外れています。dev の線は最後まで留出の線より上を走りますが、これは訓練量の効果です。各 dev フォールドは dev 行の 4/5 で訓練し、留出の数値は 1,200 行すべてを与えられたモデルから来ます。2 本の線は一緒に動くので、ループが頼りにする dev の数値は、ループが見ることのない留出の数値を追いかけます。タイトル下の区間は留出行のリサンプリングから求めたもので、ラウンド 1 からラウンド 5 への変化が 800 行のノイズより大きいかどうかを示します。

importance share は CatBoost の特徴量重要度で、38 個の質問すべての合計が 100% になるように正規化したものです。行や質問の割合でも、予測精度の割合でもありません。score 質問は平均とばらつきの 2 列を持つので、パーセンテージを出力する前にその 2 列の重要度を足し戻します。note_overall_tone_positivity が全体の 17.4% を占めます。4 行目は noul です。ノートが単一畑やその他の名声のシグナルに言及しているかどうかは真偽の事実なので、noul として尋ねられました。

次のステップ

この実行ではループを小さく保っています。直接の拡張は次のとおりです。

  • 答えるコストを払う前に候補をふるいにかけます。提案された質問そのものを状態として扱い、それについて noul を尋ねます。元のテキストから答えられるか、判定基準の下で意味が 1 つに定まるか、ほとんどの行に当てはまるか、行によって変わるか。4 つすべてを十分な信頼度で通過した質問だけを送ります。
  • 相関する特徴量を刈り込みます。dev 行でエンコード後の列間の相関を測り、ほぼ重複するものをクラスタリングし、各クラスタから最も明快な、または最も重要な質問を 1 つ残します。
  • 単純なベースラインを加えます。TF-IDF、文字数、その他の構造的特徴量を単独で比較し、それから発見した列に連結して、それぞれが何に寄与するかを測ります。
  • 提案者の系統を混ぜます。Anthropic、OpenAI、Google Gemini、オープンソースモデルで候補バッチを生成し、どれかが TypeSafe に届く前に統合して重複を除きます。系統が違えば、同じ提案者を繰り返し呼ぶよりも探索が広がるはずです。
  • 予測モデルと手法を比較します。線形回帰やエラスティックネット回帰、サポートベクター回帰、ランダムフォレスト、下流の出力が確率的な場合の再較正を試します。発見した特徴量が CatBoost の外でも役立つかを確認します。
  • 埋め込みのベースラインを加えます。埋め込みはノートを、質問を伴わない数百個の数値に変えます。sentence-transformers/all-MiniLM-L6-v2 はローカルで動き、OpenAI の text-embedding-3-small はホスト型の呼び出しです。どちらかを発見した列に連結し、それらが持っていない何かを持っているかを測ります。
  • 検証をデプロイに合わせます。将来を予測するときは時系列分割を、関連する行を一緒に保つ必要があるときはグループ分割を使い、特徴量発見とモデル選択のどちらも触らない最終テストセットを残します。
  • 頭打ちで止めます。交差検証 RMSE が一定ラウンド数だけ改善しなくなったとき、または質問数やリクエスト数の予算に達したときにループを終えます。
  • エージェントの Goal モードでより長い探索を実行します。明示的な指標、予算、停止規則を与え、さらに多くのラウンドを提案・評価・改善させます。
  • 安定性を確認します。シードやデータスライスを変えて発見を繰り返し、1 つの分割だけに重要度が依存している質問ではなく、ずっと役に立つ質問を残します。
